Efficient Finetuning for State Space Models: State-Offset Tuning
State Space Models (SSMs) are gaining increasing importance as an efficient alternative to transformers, as they reduce the quadratic computational complexity of the latter. However, the application of Parameter-Efficient Fine-Tuning (PEFT) to SSMs has been little explored so far. In particular, prompt-based methods like Prompt Tuning and Prefix-Tuning, which are widely used in transformers, do not show satisfactory performance with SSMs.
A promising approach to optimizing SSMs lies in so-called state-based methods. This new class of methods arises from the architectural properties of SSMs and focuses on the direct adaptation of state features, instead of relying on external prompts. This eliminates the need to introduce additional parameters, increasing the efficiency of finetuning.
An innovative state-based PEFT method is State-Offset Tuning. This method directly influences the current state of the model at each time step. This direct adaptation achieves more effective adaptation to specific tasks. In contrast to prompt-based methods, which manipulate the input, State-Offset Tuning acts directly on the internal representation of the model. This allows for more precise control of the model's behavior and leads to improved performance.
The effectiveness of State-Offset Tuning has been demonstrated in extensive experiments with various datasets. The results show that state-based methods, especially State-Offset Tuning, are significantly superior to prompt-based methods when applied to SSMs. The direct manipulation of the state allows for finer adaptation of the model to the respective task and leads to a significant improvement in accuracy.
